SDXL invisible watermark: apply_watermark encodes float input, and about a third of outputs are not detected by Stability's detect.py #15025

Describe the bug

StableDiffusionXLWatermarker.apply_watermark passes a float32 array in [0, 255] to imwatermark.WatermarkEncoder.encode(..., "dwtDct"). Stability's detector (scripts/demo/detect.py in Stability-AI/generative-models) reads the saved file with cv2.imread, so it decodes uint8. On many images the watermark that diffusers embeds is not found by that detector. The same image, with the same 48 bits embedded from uint8 input, decodes.

This follows up on #6292 / #7013 (RGB→BGR order, merged 2024-04-26). That fix is in place; this is a separate problem in the same function. Stability-AI/generative-models#329 reports an sdxl-turbo output from diffusers that detect.py did not detect (27/48). That report may be the same problem; we have not checked their image.

What we measured. No SDXL generation was run. Existing images were converted to the tensor that apply_watermark receives (img / 127.5 - 1, float32, 1×3×H×W), then passed through apply_watermark and VaeImageProcessor.postprocess(output_type="pil"), saved as PNG and decoded with the detect.py method. diffusers 0.41.0, invisible-watermark 0.2.0, CPU, OpenCV 5.0.0 and 4.14.0 (same results). "Not detected" means 33 or fewer of 48 bits match, which detect.py reports as "No watermark detected" or "Partial watermark match".

image set images where the uint8 path embeds the mark (≥ 41/48) apply_watermark output not detected
60 DALL·E 3 images, 1024×1024 (public dataset ProGamerGov/synthetic-dataset-1m-dalle3-high-quality-captions) 47 17 / 47 (one decodes as 2/48, a near-complete bit inversion)
all PNG and JPEG images directly in folder diffusers/ of huggingface/documentation-images (revision df6c7e68) that are at least 256 px wide and 256×256 px in area 184 of 258 (2 others already carried the mark and are excluded) 56 / 184 (3 more decode as 34–35, "Likely watermarked")

The repro below uses one image from the second set.

Cause: part measured, part hypothesis.

  • Measured: rounding, clipping and casting to uint8 before encode makes all 47 images in the first set decode (44–48/48). In this setup the result is identical to the uint8 path on every metric we recorded, for all 60 images.
  • Measured: the mark that apply_watermark embeds can be read when the decoder also gets float input (cv2.imread(...).astype(np.float32)): 45/47.
  • Measured: cv2.cvtColor(..., cv2.COLOR_BGR2YUV) on the pixel BGR (200, 120, 40) gives U = 175 as uint8 and U = 47.14 as float32. The uint8 path adds a 128 offset to the chroma channels. The float path does not.
  • Hypothesis (not proven): the dwtDct method embeds in the U channel and quantizes coefficient magnitudes. Without the 128 offset, many coefficients that the encoder selects are negative. After the image is saved as uint8, the decoder sees the offset values, and it reads different magnitudes and sometimes different positions. Images that fail have more negative selected coefficients (median share 0.80 against 0.46 for images that pass), but the two groups overlap.

The float path comes from the reference implementation. WatermarkEmbedder in Stability-AI/generative-models (sgm/inference/helpers.py, commit e8cd6576) also passes 255 * image as float to encode. We copied that class and ran it the same way (input in [0, 1]). It was not detected on 16 of the 47 images (diffusers: 17), and the two agree on 44 of the 47.

Scope in diffusers. On main (08d6977), src/diffusers/pipelines/stable_diffusion_xl/watermark.py is byte-identical to 0.41.0. StableDiffusionXLWatermarker is imported by 18 pipeline files: SDXL text2img, img2img, inpaint and instruct-pix2pix; ControlNet SDXL (3) and ControlNet Union SDXL (3); PAG SDXL (5); LEDITS++ SDXL; and deprecated ControlNet-XS SDXL and text-to-video-zero SDXL. The modular SDXL decoder (modular_pipelines/stable_diffusion_xl/decoders.py) also calls components.watermark.apply_watermark. All of them use this one method, so one change covers all of them.

Not changed by the fix. The uint8 cast does not change how many pixels move. In the 47 images of the first set where the uint8 path embeds the mark, on average 3.97% of pixels move by more than 8 levels in at least one channel with apply_watermark and 4.00% with the uint8 cast, so this does not address the artifacts discussed in #6292 / #7013. Some images do not take the mark even with uint8 input (13/60 and 72/258 above). That is outside this report. On the first set the fix did not change it; we did not run the fix on the second set.

Fix proposal (no PR yet). This is the change we tested. We can open a PR if a maintainer agrees with the approach.

         images = (255 * (images / 2 + 0.5)).cpu().permute(0, 2, 3, 1).float().numpy()
+        images = np.clip(np.round(images), 0, 255).astype(np.uint8)

         # Convert RGB to BGR, which is the channel order expected by the watermark encoder.
         images = images[:, :, :, ::-1]

         # Add watermark and convert BGR back to RGB
-        images = [self.encoder.encode(image, "dwtDct")[:, :, ::-1] for image in images]
+        images = [self.encoder.encode(np.ascontiguousarray(image), "dwtDct")[:, :, ::-1] for image in images]

-        images = np.array(images)
+        images = np.array(images).astype(np.float32)

Trade-off: watermarked images are quantized to 8-bit levels before postprocess. That changes nothing for output_type="pil", but "np" and "pt" outputs become 1/255-step values when the watermarker is enabled.

    @modelpath-dev

    Can I pick this up? In apply_watermark (sdxl watermark.py) the encoder gets a float32 array, while detect.py reads a uint8 png.
    I'd round, clip and cast to uint8 before encode, then cast back for the torch conversion, and add a CPU test that decodes the bits from the uint8 result.

    Thanks. We won't open a competing PR, so please go ahead from our side; the approach is the maintainers' call. Your plan matches the diff in the issue, which is the version we tested.

    For the CPU test, use an input that takes the mark when the encoder gets uint8. In our first set, 13 of 60 images stayed below 41/48 even with uint8 input. The repro image above decodes 48/48 that way.
